Most AI pipeline architectures assume data flows freely. In GDPR-regulated environments, every data movement is a compliance event. Here's how to architect pipelines that are both performant and compliant.
The Core GDPR Challenges for AI
- Purpose limitation — Data collected for one purpose can't be repurposed for model training without a legal basis
- Data minimization — Training sets should only contain data that's actually necessary
- Right to erasure — When a user requests deletion, their data must be removed from training sets AND the model must not retain their information
- Data portability — Users can request their data in a machine-readable format
- Cross-border transfers — Training data can't flow to non-adequate countries without safeguards
Pattern 1: Federated Feature Store
Instead of centralizing all data into one training lake, implement a federated feature store. Data stays in its source system (within its jurisdiction and purpose scope). Features are computed locally and only aggregated statistics or embeddings — not raw personal data — flow to the training pipeline.

Add calibrated noise during training to provide mathematical guarantees that individual records can't be extracted from the model. This addresses the "machine unlearning" problem — if individual contributions are provably masked, erasure requests become manageable.
Pattern 3: Consent-Aware Data Routing
Tag every data record with its consent basis and purpose. The pipeline infrastructure enforces routing rules: only data with appropriate consent reaches each training job. Consent revocation automatically triggers pipeline reconfiguration.

Every data access, transformation, and model training run is logged to an append-only audit store. This provides the "accountability" GDPR requires — you can demonstrate exactly what data was used, when, and for what purpose.
Infrastructure Requirements
These patterns require infrastructure capabilities most off-the-shelf MLOps platforms don't provide: fine-grained data lineage, policy-as-code enforcement, automated consent propagation, and jurisdiction-aware scheduling. This is purpose-built infrastructure, not Jupyter notebooks with a compliance checklist.
