AI Act Data Governance: Infrastructure for Training Data Quality, Bias, and Lineage

Article 10 of the AI Act requires rigorous data governance for high-risk AI. Here's the infrastructure to ensure training data quality, detect bias, and maintain complete lineage.

Article 10 is arguably the most technically demanding requirement of the AI Act. Training, validation, and testing datasets must be "relevant, sufficiently representative, and to the best extent possible, free of errors and complete." For infrastructure teams, this requires automated data quality, bias detection, and lineage tracking at every stage of the ML pipeline.

Data Quality Infrastructure

Automated Validation Pipeline

Every dataset used for training must pass automated quality checks:

  • Schema validation — Expected columns, data types, value ranges (Great Expectations, Pandera)
  • Statistical profiling — Distribution analysis, outlier detection, missing value assessment
  • Freshness monitoring — Data staleness detection, pipeline delay alerting
  • Cross-dataset consistency — Referential integrity across joined datasets
  • Labeling quality — Inter-annotator agreement scores, labeling error detection

Bias Detection Infrastructure

Article 10(2)(f) requires examination of data for "possible biases that are likely to affect health and safety or fundamental rights." Build automated bias scanning:

  • Representation analysis — Demographic distribution in training data vs. target population
  • Label bias detection — Differential labeling rates across protected groups
  • Historical bias analysis — Patterns in historical data that encode past discrimination
  • Proxy variable detection — Identify features that correlate with protected characteristics

Data Lineage and Provenance

  • End-to-end lineage tracking — From raw data source through every transformation to model feature (OpenLineage, Marquez)
  • Consent tracking — Which data subjects consented to which processing purposes
  • Source documentation — Automated capture of data source metadata, collection methodology, temporal scope
  • Versioning — Dataset versioning with reproducibility guarantees (DVC, LakeFS)

The Compliance Evidence Chain

Every model deployed must trace back to: its training data, the quality checks that data passed, the bias assessments performed, the lineage from source to feature. This evidence chain is what you present to conformity assessment bodies. Build it into the pipeline, not as a post-hoc exercise.
